Keep preprocessing inside the model experiment

Prevent evaluation information from entering the training process through data transformations.

The model is only part of the pipeline

The scikit learn pitfalls guide explains inconsistent preprocessing and data leakage. Transformations learned from data can affect evaluation when they are fitted outside the intended training process. A classifier may appear to improve while the experiment has actually gained information from records meant to represent unseen cases. [1]

Trace every fitted transformation

List the operations applied before the estimator, including imputation, scaling, feature selection, and other learned steps. Identify which operations have fitted state and which inputs they receive during each experiment. Keep the validation split fixed while checking this path. Save enough information to reproduce both the preprocessing and the estimator.

A pipeline is useful when it makes the relationship between fitted transformations and training explicit. Review the full process rather than checking only the final estimator call. Look for transformations that were prepared once using the whole dataset and then reused during validation. Examine duplicate or related records as well, because they can undermine the intended separation even when the code uses a pipeline.

Recheck delivery with new data

Test the saved workflow on records processed as they would be in the actual application. Confirm that the same feature ordering, units, and transformations are used. Keep an inspectable error when an input does not match the expected schema. A reproducible model delivery is the complete processing path, not just the estimator weights. This makes evaluation more meaningful and helps separate a genuine model limitation from an integration mistake.
